Structured documentation artifacts that describe a machine learning model's intended use, performance characteristics, limitations, and ethical considerations.

What You Need to Know

Model Cards are standardized documentation templates for machine learning models, introduced by Google researchers in 2019 and subsequently adopted across the AI industry. A Model Card accompanies a trained model and provides essential information for anyone evaluating whether to use the model: what it was trained to do, what data it was trained on, how its performance was evaluated, on what demographic subgroups it was tested, known limitations and failure modes, and guidance on appropriate and inappropriate uses. Model Cards serve as the primary transparency artifact bridging model developers, deployers, and end users.

The core sections of a Model Card include model details (developer, version, training date, type, contact information), intended use (primary use cases, users, out-of-scope uses), factors (demographic, environmental, and instrumentation variables that affect performance), metrics (the evaluation measures used and why they were chosen), evaluation data (datasets used for benchmarking), training data (description of training data and any preprocessing), quantitative analyses (disaggregated performance results across demographic and contextual factors), and ethical considerations and caveats. The disaggregated performance section is particularly important: many models perform well on aggregate metrics but show significant disparities in accuracy across demographic groups defined by race, gender, age, or geography.

Regulatory pressure is making Model Cards from best practice to legal requirement. The EU AI Act requires technical documentation for high-risk AI systems that substantially overlaps with Model Card content: training data description, system architecture, performance metrics, accuracy, robustness and cybersecurity, human oversight measures, and technical limitations. The US Executive Order on AI directed agencies to develop standards for AI documentation. Financial regulators in the US (OCC, Federal Reserve), UK (FCA), and EU (EBA) have issued guidance on model risk management that effectively mandates Model Card-equivalent documentation for models used in credit, trading, and insurance. Healthcare AI regulations similarly require documentation of intended use, training population, and performance characteristics.

Effective Model Cards require organizational process, not just a documentation template. Model Card completion should be a gate in the ML deployment pipeline — models that have not produced a complete, reviewed Model Card should be blocked from production deployment. Model Cards should be versioned alongside the model, updated when the model is retrained or its deployment context changes, and linked in the model registry alongside the model artifact. Automated tooling can pre-populate sections from experiment tracking and evaluation pipeline outputs, reducing the burden on data scientists. Organizations that treat Model Cards as living documents, rather than one-time compliance checkboxes, build the institutional knowledge needed to manage AI responsibly as regulatory requirements mature.
